A successful AI demonstration shows that an approach might work. A production system must continue to work as inputs change, integrations fail, and real users encounter situations that were missing from the demonstration.
The transition is an engineering and operational exercise as much as a modeling exercise.
Evaluate the cases that matter
Build an evaluation set that reflects real work, including ambiguous inputs, missing information, and important failure cases. Measure the properties that matter for the task, rather than relying on a single aggregate score.
For a document-processing workflow, for example, a missing amount, an incorrect supplier, and a formatting difference may have very different consequences. Evaluation should reflect those differences.
Plan for uncertainty and failure
Define what happens when the system cannot produce a reliable result or a dependency becomes unavailable. Depending on the workflow, the appropriate response might be to request more information, queue the work for review, or fall back to an existing process.
- Give each integration a timeout and a clear error path.
- Make retries safe so they do not duplicate business actions.
- Keep sensitive data out of unnecessary logs.
- Require human review where an incorrect action would carry significant consequences.
Monitor the whole workflow
Watch service availability, response time, processing cost, input quality, and task outcomes. A model can continue returning responses while the surrounding workflow stops producing useful results.
Assign an owner to alerts and document how to investigate a problem. Track versions of models, prompts, configuration, and evaluation results so changes can be explained and reversed.
Roll out with evidence
Start with a limited scope and compare outcomes with the established process. Gather user feedback, investigate exceptions, and expand only when the system meets the agreed criteria.
Production readiness comes from repeatable evaluation, observable behavior, and clear responsibility—not from the demonstration alone.
